Production Vector Database Patterns

This is the capstone lesson. You have the theory — embeddings, indexes, hybrid search, eval methodology. Now we assemble the operational patterns that keep vector search reliable at scale: ingestion pipelines, caching layers, update strategies, cost controls, and incident response.

Intuition First: The Newspaper Printing Press

A vector database in production is like a newspaper printing press, not a handwritten journal.

The press (ingestion pipeline) runs on schedule: new articles (documents) arrive, get edited (chunked), translated (embedded), and printed (upserted). Unchanged articles aren't reprinted (change detection). Retracted articles get pulled (deletion).

The newsstand (search API) serves readers (queries) fast. Popular editions are pre-stacked (cache). If the press breaks, yesterday's papers still sell (graceful degradation).

The editor (eval harness) reads every edition and flags quality drops before readers notice.

Your vector database is the press + newsstand. The original documents in S3/Postgres are the source manuscripts — always preserve those.

Invalidate search result cache on document updates. Embedding cache survives document updates (query text hasn't changed).


Handling Updates and Deletions

Embedding Model Migration

The most complex production operation. Plan as a formal project:

Phase 1: Build new index with new embedding model (parallel to old)
Phase 2: Run eval harness — compare recall@5 old vs new
Phase 3: Dual-write queries to both indexes (shadow mode)
Phase 4: Switch traffic to new index
Phase 5: Monitor for 1 week
Phase 6: Decommission old index

Never switch embedding models in-place. Vectors from different models are incompatible.

Failure Modes in Production

Silent index corruption. Vector count drops overnight; no alert fired. Fix: daily describe_index_stats() check against expected count.

Embedding model version drift. Dev uses 3-small, prod accidentally uses 3-large. Fix: validate model name at startup; store in vector metadata.

Cache serving stale results after update. User updates doc but cache returns old chunks. Fix: invalidate search cache on any upsert/delete for that doc_id.

Ingestion pipeline double-processing. Two workers ingest the same document concurrently. Fix: idempotent IDs + distributed lock or content-hash check.

Cost explosion from missing cache. FAQ bot with 10K daily users × embed per query = $6/month unexpectedly. Fix: embedding cache + monitor API usage.
